Self-regularized flow language models cut training wall-clock by up to 7.7x by teaching a model from its own denoising trajectory

AspireAI community · arXiv
SERF improves continuous diffusion language models by making the denoising trajectory itself the training signal. An exponential-moving-average teacher receives a cleaner version of the student's noisy input along the same interpolation path and supplies extra supervision, in two variants: one that aligns intermediate representations with deeper teacher representations, and one that aligns output token distributions. Across three continuous-LM paradigms — one-hot flow, latent and hyper-spherical — SERF delivered up to 7.7x faster wall-clock training on OpenWebText, a 24.3% MAUVE improvement and up to 28.8% higher GSM8K accuracy. The result that may matter more is the last one: SERF matched baseline quality with up to 64x fewer sampling steps, with no external pretrained model and no change to the inference procedure.

THE BIG PICTURE
A FRESH PERSPECTIVE

One distance function matched sparse-autoencoder features across layers and compressed feature circuits into supernodes
Two sparse-autoencoder analyses have resisted scaling: matching semantically similar features across layers, and compressing large feature circuits into interpretable supernodes. This paper argues both are the same underlying problem, estimating semantic distances between SAE features that sit on different activation manifolds. Its representation treats each feature not as a single decoder vector but as an activation-weighted distribution over the hidden states expressing it, projects those distributions into a shared reference space, and compares them with Wasserstein distance. The representation is proved invariant to activation rescaling and stable under perturbation, and recovers true matches under finite-sample margin conditions. Empirically it outperformed decoder-vector and LLM-based baselines and captured subtle functional distinctions between related features, and it compressed large feature circuits into interpretable supernodes automatically. The limitation is that this is interpretability tooling: the paper demonstrates better feature matching and circuit compression, not that downstream interpretability claims become more accurate.
