A tabular foundation model that explains itself: TICL3 matches in-context accuracy and shows its work

AspireAI community · arXiv (TICL3)
TICL3 pairs a tabular foundation model with a plain linear rule so the same model both makes and explains a prediction: a shared linear model captures dataset-level effects, and a second linear model fitted to residuals on foundation-model-retrieved neighbours corrects errors among similar samples, with the combined coefficients giving each feature's contribution. Across 386 classification benchmark-dataset evaluations it trails TabICLv2 by 1.1 percentage points and beats CatBoost in 266 of them, and it lifts average support F1 over MAPLE by 4.7 points. The authors report the best performance on both real-data selected-feature utility metrics, although the approach is evaluated only on tabular classification, not on the sequential or multi-modal tasks where post-hoc attribution is hardest.

THE BIG PICTURE
A FRESH PERSPECTIVE

One distance function matched sparse-autoencoder features across layers and compressed feature circuits into supernodes
Two sparse-autoencoder analyses have resisted scaling: matching semantically similar features across layers, and compressing large feature circuits into interpretable supernodes. This paper argues both are the same underlying problem, estimating semantic distances between SAE features that sit on different activation manifolds. Its representation treats each feature not as a single decoder vector but as an activation-weighted distribution over the hidden states expressing it, projects those distributions into a shared reference space, and compares them with Wasserstein distance. The representation is proved invariant to activation rescaling and stable under perturbation, and recovers true matches under finite-sample margin conditions. Empirically it outperformed decoder-vector and LLM-based baselines and captured subtle functional distinctions between related features, and it compressed large feature circuits into interpretable supernodes automatically. The limitation is that this is interpretability tooling: the paper demonstrates better feature matching and circuit compression, not that downstream interpretability claims become more accurate.
