Instead of LoRA, a single optimized image adapts a frozen multimodal model and cuts the vLLM serving slowdown from 13-93 percent to 6-14 percent

AspireAI community · arXiv (cs.CL)
Serving many task-specific adapters at throughput forces adapter-aware infrastructure, because both LoRA weight edits and soft prompts change how an already-optimized model has to be served. Art-Based Reinforcement Training optimizes a single auxiliary input image that is included in every standard multimodal prompt, leaving the frozen model and the serving engine untouched. Across five reasoning benchmarks and four small multimodal LLMs from three architectures, ART ranked first or second in 10 of 20 benchmark-model pairs, was significantly ahead of the next best adapter in 2 cases and within noise in 6, and beat the text-only baseline in 18; in the vLLM stack it cost 6-14 percent throughput against LoRA's 13-93 percent slowdown. The limitation: different methods win on different tasks, so ART is a peer of LoRA rather than a replacement, and the artifacts are plain images whose value is tied to the specific base model they were optimized against.

THE BIG PICTURE
A FRESH PERSPECTIVE
Research
One distance function matched sparse-autoencoder features across layers and compressed feature circuits into supernodes
Two sparse-autoencoder analyses have resisted scaling: matching semantically similar features across layers, and compressing large feature circuits into interpretable supernodes. This paper argues both are the same underlying problem, estimating semantic distances between SAE features that sit on different activation manifolds. Its representation treats each feature not as a single decoder vector but as an activation-weighted distribution over the hidden states expressing it, projects those distributions into a shared reference space, and compares them with Wasserstein distance. The representation is proved invariant to activation rescaling and stable under perturbation, and recovers true matches under finite-sample margin conditions. Empirically it outperformed decoder-vector and LLM-based baselines and captured subtle functional distinctions between related features, and it compressed large feature circuits into interpretable supernodes automatically. The limitation is that this is interpretability tooling: the paper demonstrates better feature matching and circuit compression, not that downstream interpretability claims become more accurate.
